But then later he came to realize, this woman is not just typical woman in the harem, she doesn't settle for wealth and position but she interferes the palace's issues to a level that it harms Yuan Qi's embezzlement...

Just be patient, later episodes will tell you the history and background, it is NOT an insta love at all. There are so much more to it, trust me this is not just a maid and crown prince falling in love and face the whole typical harem fight... It's nothing about that at all.
